Decision Intelligence: From Data to Action in Real Time

Data warehouses and dashboards show what happened. Decision intelligence shows what to do next. Here's how to build systems that enable operational decisions.

The Data-to-Decision Gap

The Problem with Traditional BI

Most enterprises have:

  • Data warehouses with petabytes of data
  • Dashboards showing every metric
  • Reports generated daily, weekly, monthly

But decisions are still slow:

  • Inventory shortage detected: 3 days after it happened
  • Customer churn signal: Noticed in quarterly review
  • Fraud pattern: Discovered in monthly audit
  • Performance degradation: Found when customers complain

The gap: Data shows what happened (past), not what to do (future).

What is Decision Intelligence?

Decision intelligence combines:

1. data: Events processed as they happen

2. Predictive models: ML models that forecast outcomes

3. Decision automation: Systems that act on predictions

4. Human-in-the-loop: Humans make high-stakes decisions, systems handle routine ones

The result: Decisions made in minutes, not days.

Architecture for Decision Intelligence

Layer 1: Data Ingestion

Event Streaming: Capture events as they happen

  • Tools: Kafka, AWS Kinesis, Azure Event Hub
  • Sources: Application logs, user actions, IoT sensors, transactions
  • Volume: Millions of events per day

Stream Processing: Process events in

  • Tools: Flink, Spark Streaming, Kafka Streams
  • Operations: Filter, aggregate, enrich, join
  • Latency: <1 second

Layer 2: Feature Store

What is a Feature Store?

Centralized repository of ML features (engineered data used by models).

Why it matters:

  • Consistency: Same features in training and production
  • Reusability: Features shared across models
  • Freshness: feature updates

Tools: Feast, Tecton, AWS SageMaker Feature Store

Example Features:

  • Customer: Total purchases (last 30 days), average order value, churn risk score
  • Product: Inventory level, sales velocity, price elasticity
  • Transaction: Fraud risk score, payment method, location

Layer 3: Predictive Models

Model Types:

Classification: Predict categories

  • Fraud detection: Fraud / Not Fraud
  • Churn prediction: Will Churn / Won't Churn
  • Quality control: Pass / Fail

Regression: Predict numbers

  • Demand forecasting: Expected sales next week
  • Price optimization: Optimal price for maximum revenue
  • Inventory planning: Stock level needed

Anomaly Detection: Identify unusual patterns

  • System performance: Latency spike, error rate increase
